However, GNSS suffer fro signal blocage and degradation in urban areas. At the sae tie, ost land vehicles, nowadays, coe with low-cost low-power Inertial Measureent Units (IMU). Although these IMU can be used an accurate short-ter tracing syste using Inertial Navigation Systes (INS) technology, they are currently ostly used only for safety applications. This paper proposes an enhanced land-vehicles tracing syste by integrating a reduced IMU syste with GPS to enhance the tracing accuracy of land vehicles in downtown and urban areas. Coonly, GPS/INS integration is based on Kalan Filter (KF), where a linearized dynaic odels for INS errors is utilized. If Low-Cost MEMS-based inertial sensors with coplex stochastic error nonlinearity are used, perforance degrades significantly during short periods of GPS-outages. This paper presents a nonlinear INS-errors odelling using a fast nonlinear identification technique called fast orthogonal search (FOS). During reliable GPS coverage, the corrected vehicle state and sensors easureents are input to FOS and the FOS odels outputs are trained to predict the INS deviations fro GPS. During GPS-outages in urban areas, the trained FOS odels along with the ost recent vehicle state are used to predict INS deviations fro GPS. The predicted INS deviations are then feedbac to the syste Kalan Filter, as updates to estiate all INS errors. The experiental setup of this wor used a very low-cost IMU fro Crossbow Inc. (USA based), the vehicle odoeter easureents along with a GPS receiver fro Novatel, Inc. (Canada based). Experients were perfored in Kingston, Ontario, Canada. Initial results show proising iproveent of tracing accuracy in challenging GNSS-denied areas. Keywords-Land Vehicles Tracing; Reduced IMU; GPS; INS/GPS integration. I. INTRODUCTION Inertial Navigation Systes (INS) utilize inertial sensors to provide navigation inforation continuously with tie [1][12][24]. In a Strapdown 3D INS with full Inertial Measureents Unit (IMU) [24][25], three acceleration sensors (Acceleroeters) and three angular rate sensors (Gyroscopes) are utilized. The acceleroeters easure the acceleration of the oving body in three orthogonal directions. Gyroscope easures the rotation rate around these three basic orthogonal axes. The essential functions in INS are defined as follows: 1) Deterination of the angular otion of a vehicle using gyroscopic sensors, fro which its attitude relative to a reference frae ay be derived. 2) Measure the acceleration using acceleroeters. 3) Resolve the acceleration easureents into the reference frae using the nowledge of attitude. 4) Account for the gravity coponent. 5) Integrate the resolved accelerations to estiate the velocity and position of the vehicle. Although INS systes have good short ter accuracy, there are two ain probles in using such a schee. The first proble is the sensor iperfections and drifts [2][8]. The second proble is that the easureents of such sensors ust be atheatically integrated to provide velocity, position, and attitude inforation. Integration causes errors to accuulate [2][8] resulting in huge drifts over tie that growth without bounds. On the other side, GPS systes provide consistent long ter accuracy giving position and velocity updates using GPS satellites signals processing [1][12]. A ajor proble of GPS is signal blocage and ulti-path in urban canyons, under buildings, and tunnels. In these environents, signal ay be difficult to acquire or nuber of satellites available ay be not sufficient to provide position inforation [25]. Based on the copleentary error characteristics of INS and GPS, an integrated solution using both systes is often used. Although there are any approaches to fuse data fro both systes, KF is ost widely used [1][12][19]. KF utilizes an error dynaic odel of the INS syste errors to ipleent two ain steps: Prediction step and Update step. Prediction step is done as long as no GPS update is available. In this step, the syste uses the error dynaic odel to estiate the INS errors. In the update step, GPS velocity and position easureents are used to get optial estiate of INS errors. Thus, by subtracting INS errors fro the INS output, accurate navigation inforation is obtained. This integration schee is called loosely coupled which is utilized here in this wor. This schee is shown in Fig. 1. The challenge with INS/GPS systes is that during GPS 16

This leads to poor errors estiates during GPS outages. Thus, the perforance degrades significantly during GPS outages. This paper presents an enhanced GPS/Reduced INS integrated navigation syste that is based on nonlinear systes identification technique called Fast Orthogonal Search (FOS). The novelty aspects of this wor lies in the utilization of fast nonlinear odeling of INS errors using FOS. Copared to existing linear estiation, such as KF [1], and existing nonlinear filtering techniques such as Particle Filter [28], the utilization of FOS is significantly faster and ore reliable. Moreover, these ethods use odels with sophisticated paraeters that need to be estiated during good GPS availability, which add coplexity and coputational load to the navigation syste. The priary objectives of this research is as follows: To propose a KF algorith with new GPS outage bridging schee to itigate large drifts during GPS outages. The bridging technique should not add uch coplexity to the integrated INS/GPS solution to be suitable for real-tie realization. To provide this INS/GPS vehicular navigation syste at low cost using a reduced IMU consists of single vertical gyro and two level acceleroeter aided by vehicle speed easureents. III. Section III describes the ethodology including the reduced IMU/GPS navigation syste, the FOS algorith, and the proposed bridging technique. Section IV describes experiental wor and results. A. GPS/Reduced IMU Syste The proposed GPS outages bridging technique is realized on low-cost 3D land-vehicles tracing syste using Reduced IMU integrated with GPS, based on Kalan Filtering. A low-cost 3D Reduced IMU platfor consists of one MEMS grade vertically aligned gyroscope, two horizontal acceleroeters, and vehicle odoeter. This platfor is shown in Fig. 2. II. PROBLEM DEFINITION AND RESEARCH OBJECTIVES GPS/INS integration is based on KF, where a linearized dynaic odels for INS errors is utilized. If Low-Cost MEMS-based inertial sensors with coplex stochastic error nonlinearity are used, perforance degrades significantly during GPS-outages. Although several solutions to bridge GPS outages were introduced [4][5][6][8][9]. Majority of these solutions are based on utilizing Artificial Intelligence (AI) techniques to train INS errors estiation odel that can be used during GPS outages instead of KF update step. One proble of these bridging schees is that the resulting odels ay be over-learned the data records that they were trained on. This leads to another proble which is the short availability period of the odels. Thus, these odels ay be useful in short GPS outages, but degrade significantly if outages periods are several inutes [3-6][9]. In addition, the schee in which these bridging techniques is used is to totally depend on such AI-trained odel separately, without interaction with KF. This schee prevents such bridging techniques fro the optial estiation that KF provides. The INS error state vector p is the pitch angle (inclination), A is the aziuth angle (heading x [ r, A, p,,, h, Ve, Vn, Vu, aod, fx, f y, wz ] where aod f x, f y, wz, are errors of the odoeter-derived acceleration, transversal 17

The nonlinear vehicle state dynaic odel is generally given by x f x, u, w ) (1) where ( u are the sensors reading, and w is the noise containating sensors easureents (process noise). The detailed atheatical equations of this dynaic odel can be found in [28]. The easureent odel involves GPS velocity, position, and aziuth updates and it is given generally as z h x, v ) (2) ( where z are sub-set of Reduced INS syste error state vector whose eleents can be directly observed fro the difference between Reduced INS output and GPS easureents which are velocity, position, and aziuth. The v is the GPS easureent noise. In KF reduced INS/GPS integrated syste, both Reduced INS errors and GPS easureent dynaic odels in (1) (2) are linearized using Taylor series expansion [1] to apply Kalan Filtering. After linearization, systes odels are given by x x 1 Gu 1 w 3) 1 z Hx v (4) When GPS observations are available, deviations of Reduced INS output (position, velocity, and aziuth) fro GPS GPS easureents ( z ) is used as observations to KF which use the difference between the actual syste output GPS ( z ) and the observation ( z ) to derive the syste to correct its state which is Reduced INS error state vector. GPS Having the observations ( z z z ), Reduced INS error state x is now partially nown fro z. Hence, KF perfors the update step to estiate the coplete Reduced INS error state vector x as follows: x x K y (5) where K is the Kalan gain. Hence, Reduced INS navigation output is corrected by subtracting errors state fro it. For ore details about KF equations and Kalan gain derivations, we refer the reader to [1][12][19]. B. Fast Orthogonal Search (FOS) Orthogonal Search [26][27] is a general purpose nonlinear systes identification tool that can odel any general syste as seen in Fig. 3, and as explained in the following figure, using the following general odel: C 1 Y j[ a 0 j P e where P is a set of arbitrary candidates, a j are coefficients and e j is the residual errors. The purpose of FOS is to select the best set of candidates P and the coefficients a that iniizes e [ n ]. The candidates j P [ ] n can be any arbitrary function of syste inputs and outputs. For exaple, in an autoregressive odel, the candidates P would be the syste input delayed with specific nuber of saples ( x[ n l], l 1, 2,..., L ). The fast orthogonal search procedure aes use of the fact that it is not necessary to create the orthogonal functions W explicitly. Only their correlations with P [ n ], the data Y[ n ], and with theselves are required. By eliinating the generation of the orthogonal functions W explicitly, the FOS perforance is uch faster than existing traditional odeling techniques. This enables the FOS to wor well in real-tie applications that require superior perforance, 18

Bridging GPS outages using FOS During GPS reliable availability, we have valuable inforation that should not be ignored. We have the corrected vehicle state which is the ost accurate state estiation according to all available nowledge till the oent. In addition, we have the current sensors readings and the Reduced INS output deviations fro GPS easureents. This valuable inforation represents the error characteristics of INS or Reduced INS solution by giving us data points that ap the current vehicle state with current sensors readings (as input) and the INS or Reduced INS errors in position, velocity, and attitude (as output). If enough nuber of data points is collected in a data set in the forat shown in Table 1, a FOS odel can learn this data set apping [18] and provide predictions of data points that are not seen before in the data set we already collected. IV. EXPERIMENTAL WORK AND RESULTS The developed INS/GPS loosely coupled KF algorith was tested on physical road data records collected over two different trajectories. The set of equipent used in experients are as follows: Honeywell HG1700 AG11 tactical grade Inertial Measureent Unit (IMU), Novatel GPS receiver, CarChip E/X (8225) data logger [17] of a General Motors Passenger Van, and Laptop coputer to control the equipents and log recorded data. Novatel CDU interface software was used to record GPS and IMU data which provide USB ports interface. G2 Pro-Pac Span unit developed by Novatel provides a tightly coupled INS/GPS navigation solution, which was used as a reference to evaluate proposed technique. Fig. 6 shows the testing trajectory as it appears in GPS Visualizer tool. TABLE 1. During GPS outages, FOS equations (3) and (4) are used to predict the Reduced INS output deviations (part of error state vector x), which then are fed to KF as a virtual GPS updates to estiate all Reduced INS output errors. The echanis is shown in Fig. 4 and Fig. 5. Figure 6. Testing Trajectory The Root Mean Square error (RMSE) [8] of the horizontal position of the vehicle during GPS outage was used as a perforance easure. RMSE during 20 inutes of GPSoutage is shown in Fig. 7, which is copared with and without the FOS-bridging technique. Relationship between RMSE percentage iproveents vs GPSoutage period Fig. 8 shows the relationship between the GPS-outage period and the iproveents in RMSE obtained by applying the proposed FOS-based bridging technique. Obviously the FOS perfors better with longer GPS-outages. V. CONCLUSION AND FUTURE WORK This wor presented an enhanced ulti-sensors INS/GPS tracing systes for land vehicles using Fast Orthogonal Search (FOS) as a nonlinear identification technique. the proposed bridging schee of Kalan Filter INS/GPS tracing systes successfully prevents the large drifts that occur during long GPS outages periods. The bridging schee utilized FOS-based easureents prediction to enable Kalan Filter to perfor update step on virtual aiding easureents. Experiental results show great RMSE iproveent in longer GPS-outages. The proposed bridging schee can be used with any AI-based odeling ethod or non-linear systes identification technique. Future wor includes applying the sae echanis on full 3D IMU/GPS configuration [2] instead of the reduced IMU configuration. In this case, it is expected that ore FOS candidates ay be required [26].
